During forest operations, canopy removal results in the soil surface being vulnerable to deformation, negatively impacting soil fertility and water quality. This study utilized unmanned aerial vehicle (UAV) photogrammetry to accurately detect soil surface deformation (SSD). Two-dimensional images were safely collected on a steep slope without real-time kinematics by conducting vertically parallel flights (VPFs). A high-resolution digital surface model (DSM) with a <3 cm resolution was acquired for precise SSD detection. Using DSM of difference (DoD), SSDs were calculated from DSMs acquired in June, July, September, and October 2022. By checking spatial distances at ground control points, errors of DSM alignments were confirmed as only 11.1 cm, 3 cm, and 4 cm from July to June, September to June, and October to June, respectively. From the first month of monitoring, erosion and deposition of approximately 7 cm and 9 cm, respectively, were detected at validation points (VPs). However, from total monitoring, cumulative SSD was assessed as having deposition tendencies at all VPs, even compared to ground truths. Although UAV photogrammetry can detect SSDs, spatial distortion may occur during UAV surveys. For vegetation growth issues, UAV photogrammetry may be unable to capture data on the soil surface itself.
Furthermore, with detected SSD from the UAV-derived 3D data, this study attempted to analyze the erosion susceptibility (ES) from the timber harvesting site by developing binary classification models from machine learning (ML) and statistical algorithms. The DoD map which contains SSD from the study site were utilized as target data; independent variable, for classification model. For binary classification, the DoD map which contains the erosion heights of all pixels from the slope, were reclassified as none ES (<=5cm) and ES (>5cm) at each pixel data. For the next step, the terrain based maps, such as topographic wetness index (TWI), slopes, terrain roughness index (TRI), aspect, plan curvature (PLC), and profile curvatures (PRC), which were all derived from UAV photogrammetric DSM, were utilized for independent variables for model development. Classification models were utilized with powerful classification algorithms, such as random forest (RF), extra gradient boost (XGB) and logistic regression (LR). The dependent and independent variable dataset were trained and tested at each ML models; RF and XGB, and statistical model; LR, using stratified cross validation (SCV) for processing 10,000 samples. Moreover, for enhancements of the models performances, hyperparameter were tuned, and SCV were applied at 10% of the total dataset. The enhanced models were validated with AUC at scores of 0.63, 0.6 and 0.56 for XGB, RF, and LR, respectively. However, the enhanced models were not improve according to the acceptable performance level (AUC<0.7), which were assume to be results from the high alignment error and lack other independent variables, such as normalized difference vegetation index (NDVI), lithology, and land cover maps. Despite the clear limitations, the ES map from XGB model were able to identify ES from the wheel tracks and logging tracks, which are well known actual erosion prone area.
산림 작업은 수관을 제거하여 토양 표면이 변형 취약하도록 변형하고, 토양 비옥도와 수질에 부정적인 영향을 미친다. 본 연구는 토양 표면 변형(SSD)을 정확하게 탐지하기 위해 무인항공기(UAV) 사진측량법을 활용하였다. VPF(Vertical Parallel Flight)를 수행하여 실시간 운동학 없이 급경사면에서 2차원 영상을 안전하게 수집하였다. 정밀한 SSD 감지를 위해 해상도가 3cm 미만인 고해상도 디지털 표면 모델(DSM)을 취득하였다. DoD(DSM of Difference)를 사용하여 2022년 6월, 7월, 9월, 10월에 획득한 DSM에서 SSD를 산출하였다. 6~7월, 6~9월, 6~10월에 대한 공간적인 거리, 즉 DSM 간의 정합 오차는 각각 11.1cm, 3cm, 4cm로 나타났다. 모니터링 첫 달부터 VP(Validation Point)에서 각각 약 7 cm와 9 cm의 침식과 퇴적이 탐지되었다. 그러나 전체 모니터링에서 누적 SSD는 Ground Truth와 비교해도 모든 VP에서 퇴적되는 방향으로 증가하는 경향이 있는 것으로 평가되었다. UAV 사진 측량법은 SSD를 탐지할 수 있지만 UAV 측량 중에 공간 왜곡이 발생할 수 있음이 본 연구에서 드러났다. 초본류가 생장하는 문제의 경우, UAV 사진측량은 토양 표면 자체에서 데이터를 취득하지 못할 수 있음을 명시하였다.
또한, 무인항공 사진측량 기반의 3D 데이터에서 감지된 SSD를 활용하여 머신 러닝(ML)과 통계 알고리즘을 활용해 이진 분류 모델을 개발하여 본 벌채 대상지의 침식위험(ES) 분석을 시도하였다. 연구 대상지의 전체 SSD가 포함된 DoD 지도를 타겟 데이터, 즉, 분류 모델의 종속변수로 활용되었다. 이진 분류를 수행하기 위해 사면에서 모든 픽셀의 침식 높이를 포함하는 DoD 맵은 각 픽셀 데이터에서 None ES(<=5cm) 및 ES(>5cm)로 재분류되었다. 다음 단계에서는 무인항공 사진측량 기반의 DSM을 활용하여 TWI(Topographic Wetness Index), 경사도, TRI(Train Roughness Index), Aspect, Plan Curvature(PLC) 및 Profile Curvature(PRC)와 같은 지형 기반 맵을 생성하였고, 모델 개발을 위한 독립 변수로 활용하였다. 분류 모델을 위한 알고리즘은 Random Forest(RF), Extra Gradient Boost(XGB) 및 Logistic Regression(LR) 등, 강력한 분류 알고리즘을 활용하였다. 종속 및 독립 변수 Dataset 변수는 각 ML 모델에서 학습 및 검증되었다. RF 및 XGB, 통계 모델; LR, 10,000개의 샘플을 처리하기 위해 계층별 교차 검증(SCV)을 사용하였고, 모델 성능을 향상시키기 위해서 그리드 서치 방식으로 하이퍼파라미터를 튜닝하고 전체 데이터셋의 10%에 SCV를 적용하였다. 향상된 모델은 XGB, RF 및 LR에 대해 각각 0.63, 0.6 및 0.56의 점수에서 AUC로 검증되었다. 그러나, 개선된 모델은 높은 정합 오차 결과로 가정된 허용 가능한 성능 수준(AUC<0.7)에서 개발할 수 없었고, 정규화 식생 지수(NDVI), 암석학, 토지피복지도 등의 독립변수가 적용되지 못했기 때문으로 사료된다. 이러한 명확한 한계에도 불구하고, XGB 모델의 ES 맵은 실제 침식 유발지로 잘 알려진 wheel track과 벌채 작업로에서 ES을 식별할 수 있었다.
