The linear inverse problem exists in many applications in acoustic signal processing, such as frequency analysis, direction of arrival (DOA) estimation, and localization. High-performance solvers for linear inverse problems are essential for detection, identification, tracking, and localization of marine objects, such as surface ships and submarines. The solution of these linear inverse problems, which include frequency analyses and DOA estimations, can be expressed as a sparse solution problem, which only a few components have non-zero components. Compressive sensing (CS) with a high-resolution performance and an effective restoration performance of sparse solutions was proposed in order to solve these sparse inverse problems, which was verified for its performance in various acoustic problems. However, the CS has limitations, such as the computational burden according to the size of the linear system model and regularization parameters that control the sparsity of the solution. Therefore, we introduced machine learning based sparse Bayesian learning (SBL) and an adaptive learned iterative shrinkage thresholding algorithm (Ada-LISTA) in order to overcome these limitations and maintain a high-resolution estimation performance, and we apply/develop them as suitable solvers for the acoustic linear inverse problems.
We performed the frequency analysis in the first section by using the multiple-measurement SBL (MM-SBL). The SBL, which reconstructs sparse solutions in linear systems using a Bayesian framework, has advantages with the frequency analysis, which is due to noise attenuation and a high-resolution detection performance from the solution sparse. We improved the robustness of the SBL based frequency analysis using multiple measurements along the time domain, which included time snapshots, and the space domain, which include multiple sensors, that share common frequency components by using the characteristic of the passive sonar systems that consist of a sensor array.
We propose a new perspective target identification and tracking technique in the second section by using the characteristic of the MM-SBL that can detect the common frequency components that are present in the acoustic signal data. We performed a frequency analysis using the MM-SBL before beamforming, which is unlike the conventional target detection method, and we detected the tonal frequency components that are present in the acoustic signal data. The MM-SBL, which was based on narrowband beamforming, was performed next in order to estimate the azimuth angle where each detected frequency component is located, which the results are expressed on the frequency-azimuth (FRAZ) plot. We identified the targets using azimuth results for each detected frequency component. In addition, the path of the target can be tracked by arranging the target detection results over time, and the MM-SBL with high-resolution beamforming performance distinguish between the close targets.
We performed a passive sonar target signal frequency analysis in the third section using deep learning-based Ada-LISTA. The Ada-LISTA, which trains the model by reflecting the physical characteristic of the linear system, has a high-resolution estimation performance. We applied the following two-step training model in order to improve the detection performance of the Ada-LISTA on underwater signal data, which included 1) training the model using simulation data, which is the pre-training step, and 2) re-training the model using underwater data, which is the fine-tuning step. The trained model has a high-resolution estimation performance, and it can analyze acoustic data in real time with the advantage of low computational processing time.
The machine learning based solvers proposed in this dissertation provide a high estimation and a high-resolution performance compared to the traditional algorithm, and we verified the validity of the solvers using simulation data and underwater in-situ data. 음향신호처리에서 선형 역문제는 주파수 분석, 방위각 추정, 그리고 위치추정 등과 많은 응용 분야에 존재하며, 선형 역문제에 대한 고성능 솔버는 해양 물체 (예: 수상함, 잠수함)의 탐지, 식별, 추적 및 위치 추정에 필수적이다. 특히 주파수분석, 방위각 추정 등의 선형 역문제의 해는 소수의 성분만이 0이 아닌 희소해로 표현될 수 있다. 이러한 희소 역문제를 해결하기 위해 고해상도 성능과 효과적인 복원성능이 가진 압축센싱 기법이 제안되었으며 다양한 음향 문제에 적용되어 그 유효성이 검증되었다. 그러나 압축센싱은 선형 시스템 모델의 크기에 따른 계산 부담과 해의 희소성을 제어하는 정규화 매개변수를 지정해야 하는 한계점이 있다. 따라서 본 논문은 이러한 한계를 극복하고, 고해상도 추정 성능을 유지하기 위해, 기계학습 기반의 희소 베이지안 학습 및 Ada-LISTA를 소개하고 이를 음향 선형 역문제에 적합한 솔버로 적용/발전한다.
본 논문의 첫 번째 파트에서는 다중측정 희소 베이지안 학습법을 이용한 주파수 분석을 수행한다. 베이지안 프레임워크를 사용하여 선형 시스템의 희소 솔루션을 재구성하는 희소 베이지안 학습법은 잡음 감쇠 및 고분해능의 주파수 탐지 결과를 가진다. 희소 베이지안 학습법 기반의 주파수 분석의 견고성을 개선하기 위해, 배열센서로 이루어진 수동소나시스템의 특성을 활용하여 공통 주파수 성분을 공유하는 시간영역(시간 스냅샷)과 공간영역(다중 센서)의 다중측정을 적용하였다.
두 번째 파트에서는 음향 신호 데이터에 존재하는 공통 주파수 성분을 검출할 수 있는 다중측정 희소 베이지안 학습법을 이용한 새로운 관점의 표적 식별 및 추적 기법을 제안하였다. 기존의 표적 검출 방식과 달리 빔포밍 이전에 다중측정 희소 베이지안 학습법을 이용한 주파수 분석을 수행하고, 음향 신호 데이터에 존재하는 토널 주파수 성분을 검출한다. 이후, 협대역 빔포밍 기반 다중측정 희소 베이지안 학습법을 수행하여 검출된 각 주파수 성분이 위치하는 방위각을 추정하고, 그 결과를 주파수-방위각 플롯에 표현한다. 탐지된 각 주파수 성분에 대한 방위각 결과를 이용하여 표적을 식별한다. 또한 표적 탐지 결과를 시간에 따라 배열하여 표적의 경로를 추적할 수 있으며, 고해상도 빔포밍 성능을 가진 다중측정 희소 베이지안 학습법은 근접한 표적을 구별한다.
세 번째 파트에서는 딥러닝 기반의 Ada-LISTA를 사용하여 수동 소나 표적 신호 주파수 분석을 수행한다. 선형 시스템의 물리적 특성을 반영하여 모델을 훈련하는 Ada-LISTA는 고해상도의 추정 성능을 가지고 있다. 수중데이터에 대한 Ada-LISTA의 탐지 성능을 향상시키기 위해 다음과 같은 2단계 훈련 모델을 적용한다: 1) 시뮬레이션 데이터를 이용한 모델 학습 (사전 학습 단계), 2) 실해상데이터를 이용한 모델 재학습 (미세 조정 단계). 훈련된 모델은 고해상도의 추정성능을 가지며, 낮은 계산 처리 시간의 이점으로 실데이터의 실시간 분석이 가능하다.
본 논문에서 제안하는 기계학습 기반의 솔버들은 기존의 기법들에 비해 높은 추정 성능과 고해상도 결과를 제공하며, 시뮬레이션 데이터와 실해상데이터를 활용하여 알고리즘의 유효성을 검증하였다. 본 논문에서 제안하고 있는 기법들은 음향신호의 선형 역문제에의 적용을 중점적으로 수행하였으나, 제안된 기법은 레이더 신호처리, 영상처리, 의학 등 다양한 분야의 선형 역문제를 해결하기 위해 효과적으로 적용될 수 있을 것으로 기대된다.
