정확한 건물에너지 소비에 대한 예측은 에너지의 수요와 공급의 균형을 맞추는데 핵심적인 역할을 한다. 일반적으로, 건물의 에너지소비를 효과적으로 분석하고 예측하기 위해서는 모델에 활용되는 변수를 적절하게 선택해주는 과정이 중요하다. 특히 모델에 활용되는 변수를 추가하고 제거하는 과정은 예측 모델의 성능에 큰 영향을 미친다. 따라서 본 연구는 건물에너지 소비와 관련된 도메인 지식을 기반으로 변수를 결정하기 위한 방법들을 통하여 예측 모델의 성능을 개선할 수 있는 통합방법론에 대한 개발을 목표로 진행되었다. 본 연구에서는 중요한 변수를 선별해주는 과정을 Feature selection으로, 중요한 변수를 추출한 후 모델에 추가해주는 과정을 Feature decomposition으로 정의하였으며, 이러한 변수를 결정해주는 통합적인 과정을 Feature engineering method라고 정의하였다.
본 연구는 비주거 건물 유형에 초점을 맞추었으며, 비주거 건물의 특성이 적절하게 적용된다면 예측모델의 성능에 긍정적인 영향을 줄 수 있을 것이라는 가설을 기준으로 진행되었다. 방법론에 대한 개발을 위해서 건물의 실내 및 외부 환경 데이터에 대한 수집을 진행하였으며, 난방 및 냉방 에너지소비에 중요한 영향을 미치는 실의 조건을 분석하였다. 이때 각 건물의 데이터에 대하여 Random forest 알고리즘을 통해 에너지소비에 대한 변수들의 중요도를 분석하였으며 결과를 토대로 변수 선별이 진행되었다. 또한 수집된 데이터로부터 건물의 에너지소비 패턴을 추출하여 예측모델의 입력데이터로서 추가하여 활용하였다.
최종적으로 네 가지의 Long Short-Term Memory (LSTM) 케이스가 각 건물마다 구축되었으며, 활용된 입력데이터 종류에 따른 예측 정확도의 차이를 비교분석 하였다. 각 모델은 입력데이터 유형에 따라 다른 결과를 보였으며, 케이스는 다음과 같다: (i) Case 1 – 계측 데이터만 활용; (ii) Case 2 – Feature selection 방법을 통한 변수 선별; (iii) Case 3 – Feature decomposition 방법을 통한 에너지소비 패턴 추출 및 적용; (iv) Case 4 – Feature selection 및 Feature decomposition 방법이 모두 적용. 이 중 가장 우수한 예측 결과를 보인 케이스는 4번 케이스로, 평균 R2 값은 베이스라인 대비 난방기 약 11%, 냉방기 12%의 증가 효과를 보였다. 특히 고등학교와 같이 재실 스케쥴이 변화하는 건물의 경우, 세분화된 에너지소비 패턴의 적용을 통해 예측모델의 성능 개선에 도움이 되는 것을 확인할 수 있었다. 이때 정확도 개선효과는 R2 값 기준으로 베이스라인 대비 난방기 약 14.4%, 냉방기 17.2%로 나타났다. 따라서 본 연구에서 제안된 통합방법론의 적용은 에너지소비 예측모델에 변수에 대한 통찰력을 부여할 수 있으며, 예측모델의 성능개선에 긍정적인 영향을 미칠 수 있음이 확인되었다.
The precise prediction of building energy consumption is crucial to balancing the demand and supply of energy. In general, for effective analysis and prediction of building energy, the variables used in the model must be selected appropriately. Particularly, the process wherein variables are removed or added significantly influences the performance of the prediction model. Therefore, this study aimed to develop an integrated methodology for improving the performance of a prediction model through feature engineering method based on explainable domain knowledge of building energy consumption. This study defined feature engineering method as a way of integrating feature selection, which selects important variables, and feature decomposition, which mines latent features from the raw observations and facilitates addition of significant variables. This study focused on non-residential buildings because such building types exhibit regular patterns that originate from the properties of each building. Through the utilization of such characteristics, the prediction model can provide positive results for prediction performance. This study analyzed outdoor and indoor data collected from buildings to identify the conditions of rooms that significantly affected heating and cooling energy consumption. The importance of variables for energy consumption was analyzed through the random forest algorithm, and major variables were selected based on the results. In this study, patterns of energy consumption, which were utilized an input data for the prediction model, are extracted. Four long short-term memory (LSTM) models were created for each building, and the results were compared to examine the effect of applying the feature engineering method on the prediction performance of the LSTM model. Each model exhibited different results according to the type of the input data used: (i) case 1 – only measured data; (ii) case 2 – selected measured data by feature selection; (iii) case 3 – measured data and patterns of energy consumption; and (iv) case 4 – selected measured data and patterns of energy consumption. Among these cases, the case 4 prediction results were the superior for most cases and showed an average increase in R2 accuracy of approximately 11% and 12% for heating and cooling seasons, respectively. In particular, in the case of a building that experience change in the occupancy schedule, such as a high school, detailed patterns of energy consumption helped improve performance. Moreover, at this time, the increase rate for prediction accuracy R2 was approximately 14.4% and 17.2 % for heating and cooling seasons, respectively. Thus, the use of the proposed methodology provided new insights into variables that may have a positive influence on the prediction model.
