Piping is an important material used in construction and various industrial fields and is a material closely related to the lives of modern people. In particular non-metal pipes are used in many industries because they are superior to metal and concrete pipes such as economic efficiency and durability light weight and chemical resistance compared to metal flexibility and convenience of molding. With the development of the semiconductor industry a large amount of non-metal pipes are used and in Korea replacement history periodic inspections and maintenance are recorded and managed in preparation for deformation due to deterioration and protective measures are required. Therefore using laser scanning techniques we intend to study non-destructive inspection techniques that can maintain non-metallic pipes for the semiconductor industry which only conducts visual inspection and old-age management.
Two scenarios were constructed in consideration of the occurrence of a step due to the excessive stress load of U-bolt fixing non-metal pipes and the deformation caused by contraction and expansion due to high temperature chemicals inside the pipes. PVC and PP pipe simulation samples were manufactured on grid-shaped dry cracks caused by thickening defects and accumulation of contraction and expansion caused by the step difference. However in the case of piping it is difficult to apply a defect in the desired form when manufacturing a Test Specimen so in this study a test specimen was produced for plates with physical properties such as PP and PVC piping used in the semiconductor industry. The laser scanning results were the same for both PP and PVC. In the case of a circular softening damage the shape of the damage can be intuitively checked at a depth of 2mm or more and since it has a laser ultrasonic shape different from that of a normal test specimen the damage could be checked but the shape of the damage could not be recognized. In the case of dry crack simulation test laser ultrasonic data alone detected an intuitive lattice defect damage was also known at 4mm depth data that could faintly infer the lattice shape and at a depth of 2mm or less only damage was identified. Therefore in order to overcome the limitations of laser scanning-based data noise Filtered was performed on data measured through experiments on wall thinning defect and dry cracks that occur the most in non-metallic pipes using Median Filter. As a result in the case of wall thinning defect damage only the presence or absence of damage could be identified and in the case of dry cracks the division according to the width and the damage shape according to the depth of 4mm could be identified. However although the instrumentation performance was improved in this way only the location and shape of the damage can be known from the image data so deep learning was conducted to automate the damage information (length, width, depth, etc.) and classification.
In addition it was conducted to compare the performance of RMS and Filtered RMS obtained through experiments. For deep learning 1,500 train datasets were constructed for RMS and Filtered RMS respectively and 320 test datasets were constructed. In order to increase accuracy in deep learning the pre-trained EfficientDet algorithm and Augmentation function were used batch size was 32 and Step was 30,000 and deep learning was conducted in the same environment. Both data showed results for almost similar learning but applying Test data showed low total loss and high mAP in Filtered RMS.
Through this study it was confirmed that the performance of Filtered RMS was superior to that of the existing RMS and furthermore the information of damage (length, width, depth, etc.) and the possibility of automatic classification of damage were confirmed through deep learning application. Therefore, it is expected that efficient non-metal pipe maintenance will be possible in industries that use a lot of non-metal pipes.
배관은 건설 및 다양한 산업 분야에서 사용되는 중요한 소재이며, 현대인의 생활에 밀접하게 연관된 재료이다. 특히 비금속 배관은 경제적인 효율성과 내구성, 금속 대비 가벼운 중량 및 내화학성, 유연함, 몰딩의 편리함 등 금속 및 콘크리트 배관보다 우수하여 많은 산업에서 사용되고 있으며, 반도체 산업의 발전에 따라 많은 양의 비금속 배관이 사용되고 있다. 하지만 비금속 배관의 경우 열화에 의한 변형 등에 대비하여 교체 이력, 주기적인 점검 및 유지보수 등에 대해 기록과 관리하고, 외부 충격 등에 의해 파손될 우려가 있는 경우 보호조치를 해야 한다고 규정만 되어있다. 이에 본 연구에서는 레이저 스캐닝 기법을 활용하여 기존의 육안검사와 노후관리만 진행되는 반도체 산업을 대상으로 비금속 배관 유지관리가 가능한 비파괴 검사 기법을 연구하고자 한다.
선행적으로 금속배관 레이저 스캐닝 데이터를 대상으로 딥러닝 적용 가능성을 확인하였으며, 비금속배관(PE, PP, PVC)를 대상으로도 레이저 스캐닝 실험을 통해 적용 가능성을 확인하였고, 이에 반도체 산업의 비금속 배관을 고정하는 U-bolt의 과도한 스트레스 하중으로 인한 단차 발생과 배관 내부의 고온 화학물질로 인한 수축 팽창으로 변형이 발생하는 상황을 고려하여 2가지 시나리오를 구성하였다. 단차로 인하여 화학물질이 고인 부분으로부터 발생하는 감육 결함과 수축 팽창의 누적으로 인하여 발생하는 격자 형태의 드라이 크랙을 대상으로 PVC, PP 배관 모사 시험체를 제작하였다. 레이저 스캐닝 결과는 PP, PVC 둘 다 같았으며, 원 형태의 감육 손상의 경우 3mm 깊이에서는 손상의 형태를 직관적으로 확인 가능한 결과가 나왔지만 2mm 이하의 깊이에서는 정상 시험체와 다른 레이저 초음파의 형태를 가지기 때문에 손상의 유무만 확인이 가능하고, 손상의 형태는 알아볼 수 없었다. 드라이크랙을 모사한 시험체의 경우 깊이 8mm 에서는 직관적인 격자 형태의 결함이 검출되었으며, 4mm 깊이에서는 손상의 유무와 희미하게 격자의 형태를 유추할 수 있는 데이터가 검출되었고, 깊이 2mm 이하에서는 정상 시편 초음파 데이터와 달라 손상의 유무만 확인이 가능했다. 이에 레이저 스캐닝 기반 데이터의 한계를 극복하기 위해 Medain Filter를 활용하여, 비금속 배관에서 가장 많이 발생하는 감육과 드라이 크랙을 대상으로 실험을 통해 계측된 데이터를 대상으로 Noise Filtering을 진행하였다. 그 결과 감육 손상의 경우 손상의 유무만 확인이 가능했던 깊이 2mm의 손상의 형태를 알 수 있었으며, 드라이 크랙의 경우 깊이 8mm 손상에서는 너비에 따른 구분과 깊이 4mm의 손상 형태를 알 수 있었다. 하지만 이와 같은 방법으로 계측 성능은 높아졌지만, 이미지 데이터로는 손상의 위치와 형태만 알 수 있으므로 손상의 정보(길이, 너비, 깊이 등)와 분류 자동화와 실험을 통해 얻은 RMS와 Filtered RMS의 성능을 비교하고자 진행하였다.
딥러닝 학습을 위해 RMS와 Filtered RMS를 대상으로 각각 1,500장의 Train data로 구성하였으며, 320장의 Test data로 구성하였다. 딥러닝 학습의 정확도를 높이기 위해 사전학습된 EfficientDet 알고리즘과 Augmentation function을 활용하였으며, batch size는 32로 Step은 30,000으로 동일한 환경에서 딥러닝 학습을 진행하였다. 두 가지 데이터 모두 거의 비슷한 학습에 대한 결과를 보였지만 Test data를 적용해본 결과 Filtered RMS에서 10배 낮은 Total Loss와 0.3 높은 mAP를 보였다.
본 연구를 통해 기존 RMS 대비 Filtered RMS의 성능이 우수함을 확인하였으며, 추가로 딥러닝 적용을 통해 손상의 정보(길이, 너비, 깊이 등)와 손상 자동 분류가 가능함을 확인하였다. 따라서 비금속 배관을 많이 사용하는 산업에서 효율적인 비금속 배관 유지관리가 가능할 것으로 기대된다.
